I noticed whenever there’s a long period I don’t access my site, when I initially fire it from my browser, it takes very long to load.
But once it loaded, subsequent visits from the same device became fast again.
I think it’s something to do with caching but I need specific advice and why this is happening and on how to drastically improve the initial load time.

Lighthouse in Chrome’s Inspector will help with that. It will spit out a report in 5 minutes and give you some good things to focus on for each page.
That’s definitely caching, likely large media files.
Check the site at gtmetrix and view the waterfall report.
